In recent years, the rise of “agentic” artificial intelligence (AI) has raised questions about the future of data scientists. This Blog examines whether data scientists are becoming obsolete in the Agentic Era and argues that their role is not vanishing but undergoing a significant transformation. Finally, we explore the implications for organizations and offer recommendations on adapting to this paradigm shift. Introduction

Over the past decade, data scientists have been at the forefront of extracting insights from data, playing a pivotal role in business innovation. In 2012, the Harvard Business Review famously dubbed data science “the sexiest job of the 21st century,” describing data scientists as people who can “coax treasure out of messy, unstructured data” (Data Scientist: The Sexiest Job of the 21st Century). This reflects how valuable their skillset became in an era of big data: organizations relied on data science teams to build predictive models, personalize customer experiences, and inform strategic decisions. The foundational workflow of a data science project has remained consistent. Given these successes, it is no surprise that organizations heavily invested in data science talent and infrastructure. However, the field has continually evolved, and with each new wave of technological advancement, questions emerge about the necessity of human experts. In the past, the advent of high-level machine learning libraries and automation tools prompted speculation that the traditional data scientist might become less relevant. The introduction of Automated Machine Learning (AutoML) in particular was seen as a potential disruptor that could automate many tasks data scientists perform. If models could be trained and tuned at the push of a button, would we still need people in the loop? As we shall discuss, AutoML ultimately did not make data scientists obsolete, largely because it failed to automate the most complex and critical parts of the job.

Today, we stand on the cusp of another major shift: the rise of agentic AI. Agentic AI systems — AI “agents” that can act autonomously toward goals — have rapidly advanced due to breakthroughs in generative models and cognitive architectures. These agents can carry out multi-step analytical tasks, use tools, and make decisions with minimal human intervention. The emergence of agentic AI (sometimes called AI copilots or autonomous agents) raises the question anew: are data scientists at risk of becoming obsolete in this Agentic Era? Or, as history suggests, will their role adapt and expand in tandem with the technology? This paper argues for the latter — that while routine model development and analysis tasks may be increasingly handled by AI agents, the expertise of data scientists remains vital in new forms. In the sections that follow, we examine the limitations of AutoML as a cautionary tale, explore what agentic AI entails and how it differs from prior approaches, compare legacy data science stacks to agentic stacks, and illustrate how the data scientist’s role is evolving rather than disappearing. We then provide real-world examples of this transformation already underway and discuss the implications for organizations aiming to harness these new technologies. By understanding this landscape, organizations and practitioners can prepare to not only coexist with advanced AI agents but to leverage them, redefining the data scientist as an indispensable orchestrator of AI-driven solutions.

The Limitations of AutoML

AutoML was the first major attempt to automate the end-to-end workflow of machine learning, and many in the late 2010s wondered if it would render manual model development obsolete. Tech giants and startups alike — Google, Amazon, Microsoft, DataRobot, H2O.ai, among others — introduced AutoML platforms promising to “auto-magically” build optimal models given raw data (Are data scientists obsolete in the agentic era? — DataScienceCentral.com). In theory, AutoML pipelines handle tasks like feature engineering, algorithm selection, and hyperparameter tuning without human intervention. If successful, AutoML could have drastically reduced the need for data scientists to perform these labor-intensive steps. However, in practice AutoML failed to revolutionize the field for several key reasons.

First, AutoML solutions addressed only a narrow slice of the workflow and did not solve the hardest problems in data science (Delphina) (Delphina). Agentic AI: A New Paradigm of Autonomous Intelligence

If AutoML was about partially automating model building, agentic AI is about automating the reasoning and action around those models. Agentic AI refers to AI systems that exhibit agency — the capacity to act independently and purposefully toward a goal (What Is Agentic AI? | IBM). In an agentic AI system, a software “agent” can perceive its environment, make decisions, and execute tasks with minimal human guidance. These agents build upon advances in generative AI, especially large language models (LLMs), by not only generating outputs (text, code, etc.) but by using those outputs to take initiatives and perform multi-step operations (What Is Agentic AI? | IBM). In essence, while a traditional AI model might answer a question or make a prediction when asked, an agentic AI will go further: it can decide what questions need asking, invoke other tools or subroutines to find answers, and carry out actions to achieve an objective.

Several definitions of agentic AI emphasize autonomy and goal-driven behavior. According to IBM, “agentic AI is an AI system that can accomplish a specific goal with limited supervision”, consisting of AI agents that mimic human decision-making in real time (What Is Agentic AI? | IBM). One way to understand agentic AI is by comparing it to the earlier generations of AI tools. Traditional AI solutions, including most machine learning models, are largely reactive: they produce an output (classification, prediction, etc.) in response to an input, and that is the end of their scope (Agentic AI: How It Works, Benefits, Comparison With Traditional AI | DataCamp). They do not carry context from one query to the next, nor can they set their own objectives. AutoML, as discussed, automated some of the construction of these models but did not change their fundamental nature — the resulting model still needs to be prompted with input for each use and doesn’t take initiative beyond what it was explicitly programmed to do. Agentic AI, by contrast, endows AI with a kind of proactive problem-solving loop. Figure 1 above illustrates a generic architecture of an agentic AI system. At the heart is an Agent Core (often powered by a large language model) that serves as the decision-maker (Introduction to LLM Agents | NVIDIA Technical Blog) (Introduction to LLM Agents | NVIDIA Technical Blog). This core receives user requests or goals and is supported by additional components: a Memory Module that stores context and past events, a Planning Module that helps break down complex problems and strategize, and a suite of Tools the agent can use to act on the world (Introduction to LLM Agents | NVIDIA Technical Blog) (Introduction to LLM Agents | NVIDIA Technical Blog). In operation, when given a goal, the agent core can consult its memory (for relevant information from prior steps), devise a plan possibly with the aid of the planning module, and then call on tools to execute actions (such as querying a database, running a prediction model, or sending an alert). The process is iterative: the agent reviews the results of its actions (via feedback or further observations) and may update its approach — a capability sometimes referred to as reflection (Are data scientists obsolete in the agentic era? — DataScienceCentral.com). This design allows agents to tackle tasks too complex for a single static model, by decomposing them and handling them in a loop that resembles human problem-solving.

Several key features distinguish agentic AI systems from earlier AI approaches:

  • Autonomy and Proactivity: Agentic AI can initiate actions on its own. Rather than waiting for a specific prompt each time, an agent can run continuously, monitoring conditions and taking action when certain triggers occur. Agents can interface with databases, software applications, or even physical devices (in IoT scenarios). Moreover, it could run continuously, updating its results as new data comes in, rather than being a one-off project. Throughout, a human data scientist might oversee the process and handle exceptions, but the heavy lifting across multiple steps could be handled by the agent.

It’s important to clarify that agentic AI does not mean AI with unrestricted general intelligence — these agents are typically bounded to specific domains or goals set by humans. They excel in specific contexts like data analytics, IT operations, or autonomous vehicles, where they can be given a clear objective (find insights, keep system running, navigate to destination, etc.) and enough tools to operate. For example, in analytics, an agent might be told to “monitor sales data and explain any significant changes”. The agent will then autonomously track the data, detect anomalies or trends, and provide explanations or even suggest actions (perhaps by correlating with marketing data or external economic indicators). This goes beyond a static dashboard by having the AI actively investigate and report findings, roles traditionally performed by a data analyst.

In contrast with earlier “AI assistants” or BI chatbots that only answer predefined questions, agentic AI represents a shift to AI collaborators that can handle subtasks in pursuit of a larger goal. While early and experimental, these projects demonstrated an AI agent writing its own to-do list and iteratively completing tasks with minimal human input. Enterprise tech providers are now embedding these ideas: for instance, business intelligence platforms have started adding agents that not only answer queries but also monitor data and suggest deeper analyses to perform (Google’s Looker taking an agentic approach to generative AI | TechTarget). Agentic AI is thus positioned as a game-changer for knowledge work and analytics.

However, with this power come new challenges: agents need guardrails to avoid undesired actions, and their autonomy requires careful objective design to align with human intent. These topics relate to AI ethics and governance, which we will address later. The key point is that agentic AI dramatically expands what tasks can be automated. Unlike AutoML, which mainly helped with model-building, an agent can potentially automate significant portions of data understanding, insight generation, and even decision execution. This raises the stakes for the data science profession: more tasks can be done by AI, but also new tasks and opportunities arise for humans to guide and augment these agentic systems.

Legacy Data Science Stack vs. Agentic Stack

The shift toward agentic AI is changing the “technology stack” that organizations use for data analytics and AI. By stack, we refer to the collection of tools, frameworks, and infrastructure used to turn raw data into insights or intelligent behavior. The legacy data science stack (often dubbed the “modern data stack” in recent years) typically involves an assortment of specialized tools: data warehouses or databases for storing structured data, ETL/ELT tools for data extraction and transformation, notebooks and programming libraries for analysis (e.g. Python with pandas, scikit-learn, TensorFlow/PyTorch), and visualization or BI tools for reporting (Tableau, Power BI, etc.). This stack has delivered great value but also has well-known pain points: it is fragmented, requires technical expertise at each stage, and often incurs significant overhead in integrating all the pieces. In contrast, the emerging agentic AI stack strives for a more unified and accessible ecosystem in which AI agents can handle end-to-end data workflows, lowering the barrier for non-experts to get advanced analytical results (Are data scientists obsolete in the agentic era? — DataScienceCentral.com).

  • Data Types: Legacy data science workflows primarily handle structured data (tables, relational data).
